You should also practice good hygiene after handling chillies. You might have wondered whether athlete's foot spray could deal with a similarly infuriating itch elsewhere than between ones toes. Since that's what's in the bathroom cabinet, you might even be tempted to try it. I got blisters on Christmas Eve from secondary contact with a California Reaper. More seriously to get capsicum off your hands it may work to apply some sort of oily moisturiser and then scrub it off again with soap and water after a minute or two.

Shpalman is right. Capsaicin is lipophillic (dissolves in fats, oil, etc, rather than polar solvents like water). Milk works, but only really the full-fat milk.
